## Summary

Learned simulators that predict the next state of particles, meshes, or continuous fields with message-passing networks or Fourier-space operators, trained on numerical solver output and run 10-1000x faster than that solver.

## Mechanism

Graph network simulators treat particles (GNS) or mesh vertices (MeshGraphNets) as nodes, with edges to neighbors within a radius or along mesh connectivity. An encoder embeds positions, velocities and material type; several rounds of learned message passing compute pairwise interactions; a decoder outputs per-node accelerations that a simple integrator applies. Models are trained on one-step targets from a numerical solver, with noise added to inputs so long rollouts stay stable. MeshGraphNets also learns where to refine the mesh. Neural operators such as the Fourier Neural Operator learn a map from one function to another (for example initial vorticity to vorticity at a later time) by applying learned kernels in Fourier space, so one model covers a family of PDE instances and can be evaluated at grid resolutions not seen in training.

## Limitations

- Errors accumulate over long rollouts; GNS needed training-noise injection to stay stable, and nothing guarantees conservation of mass or energy.
- Each material or domain needs a training set generated by a numerical solver, and behavior outside the training distribution (new materials, extreme speeds, novel geometry) is unreliable.
- Reported speedups are against the high-accuracy solver used for training, not against the cheap approximations games already ship, so the net gain for a game can be much smaller.
- Inference runs on the GPU and competes with rendering for the frame budget.
- Results are cited from 2020-2021 primary papers; this run found no shipped game using GNS or neural operators at runtime.

## Relations

**affects**

- [Fluid and gas simulation](../mechanic/fluid-gas-simulation.md) (Accelerates): Learned fluid surrogates (GNS particles, FNO fields) reproduce solver-quality flow at large speedups, raising resolution or extent of water and gas within a frame budget.
- [Soft-body deformation](../mechanic/soft-body-deformation.md) (Accelerates): MeshGraphNets predicts cloth and structural deformation 10-100x faster than its training solver, allowing finite-element-like deformation where games now use coarse node-beam models.
- [Material interactions](../mechanic/material-interactions.md) (Deepens): GNS simulates several materials (fluids, rigid solids, deformables) interacting in one learned model, so mixed-material reactions need no hand-written pairwise rules.
- [Flight aerodynamics](../mechanic/flight-aerodynamics.md) (Deepens): MeshGraphNets learned aerodynamic flow around airfoils, pointing to flight models driven by surrogate CFD fields instead of fixed lift and drag coefficient tables.
- [Structural integrity](../mechanic/structural-integrity.md) (Deepens): Learned structural-mechanics surrogates output stress and deformation fields, which could replace binary support checks with graded bending, sagging and stress-driven failure.
- [Hydrology](../mechanic/hydrology.md) (Accelerates): Neural operators solve parametric flow PDEs in one forward pass at any grid resolution, a candidate replacement for per-cell iterative water-flow updates over large terrains.

## Claims

- GNS learned fluids, rigid solids and deformable materials as interacting particles; models trained on single steps with thousands of particles generalized to thousands of rollout steps and at least 10x more particles. *(confidence: high)* [[171](../source/src-sanchezgonzalez-2020-gns.md)]
- MeshGraphNets predicted cloth, structural mechanics and aerodynamics on adaptive meshes and ran 1-2 orders of magnitude faster than the simulator it was trained on. *(confidence: high)* [[172](../source/src-pfaff-2021-meshgraphnets.md)]
- The Fourier Neural Operator modeled Navier-Stokes turbulence with zero-shot super-resolution and was up to three orders of magnitude faster than traditional PDE solvers. *(confidence: high)* [[173](../source/src-li-2020-fno.md)]
